Building a Production RAG System
Retrieval Augmented Generation (RAG) has become the go-to architecture for building LLM applications that need to work with custom knowledge bases. In this post, I'll walk through building a production-grade RAG system.
Why RAG?
LLMs have a knowledge cutoff and can't access your private data. RAG solves this by:
- Indexing your documents into a vector store
- Retrieving relevant chunks at query time
- Augmenting the LLM prompt with retrieved context
Architecture
from langchain.vectorstores import Pinecone
from langchain.embeddings import OpenAIEmbeddings
from langchain.chains import RetrievalQA
from langchain.llms import OpenAI
embeddings = OpenAIEmbeddings()
vectorstore = Pinecone.from_existing_index("my-index", embeddings)
qa_chain = RetrievalQA.from_chain_type(
llm=OpenAI(temperature=0),
chain_type="stuff",
retriever=vectorstore.as_retriever(search_kwargs={"k": 5}),
)
Key Challenges
- Chunking strategy — how you split documents dramatically affects retrieval quality
- Embedding model choice — domain-specific embeddings often outperform general ones
- Re-ranking — adding a cross-encoder re-ranker improves precision significantly
Results
After tuning, we achieved 87% answer accuracy on our benchmark dataset, up from 62% with naive RAG.
Conclusion
RAG is powerful but requires careful engineering. The devil is in the details — chunking, retrieval, and prompt design all matter enormously.
